Data Drift and Concept Drift
“Drift” is not one diagnosis. Let inputs be (X), outcome be (Y), and time or environment be (t). Different changing distributions imply different questions and responses.
Prerequisites
Complete Data Quality in Production. Be comfortable with conditional probability and the Study Sprint reference cohort.
Learning goals
- distinguish covariate shift, label shift, concept drift, and performance drift.
- interpret distance metrics as evidence relative to a declared reference.
- require outcome and consequence evidence before retraining.
Worked example
The local report creates two essential counterexamples. In harmless-covariate-shift, the total-variation distance between five feature bins and the reference is 0.4, while accuracy remains 0.8 and the conditional label pattern is unchanged. In concept-drift, the covariate distance is 0.0, but the maximum label-rate change within the two score bands is 0.6 and accuracy falls from 0.8 to 0.2.
For discrete bins, the teaching example computes
The bins, reference period, sample size, and treatment of missing values are part of the metric. A value of 0.4 is not intrinsically safe or unsafe.
Use precise names:
- Covariate shift: (P_t(X)) changes. A new campaign may attract learners with more practice time without harming predictions.
- Label shift: (P_t(Y)) changes, under the strong diagnostic assumption that (P(X\mid Y)) is stable. Outcome prevalence alone cannot prove this assumption.
- Concept drift: (P_t(Y\mid X)) changes. The same recorded preparation may stop meaning the same thing after curriculum or measurement changes.
- Performance drift: a chosen realized metric changes on a specified labeled population. It is an observation, not a causal diagnosis.
These can coexist. Data quality failure can imitate drift. Selection into the labeled set can imitate excellent performance. Seasonality can move (P(X)). Policy changes can alter both exposure and (Y\mid X). Investigate lineage, cohort definitions, slices, and interventions before naming a cause.
From signal to decision
Set thresholds from false-alarm cost, detection delay, sample size, natural variation, and consequence—not a universal divergence number. A warning should create a hypothesis and evidence plan. Retraining is justified only when a validated failure mode has a suitable candidate, representative data, evaluation, approval, rollout, and rollback plan.
Common mistakes
- Calling covariate shift “concept drift” without labels.
- Calling lower accuracy “data drift” without investigating the cause.
- Treating label prevalence change as proven label shift.
- Changing histogram bins until an alert disappears.
- Automatically retraining from a single divergence threshold.
Practice
For each simulated window, write what changed among (P(X)), (P(Y)), (P(Y\mid X)), and measured performance. Mark what is observed, what is assumed, and what remains unidentified.
Next steps
Continue with Monitoring with Delayed Labels, where even (Y) is incomplete and selected.
